My name is Alan and I have a LLM. I want to understand bias. Then mitigate it. Maybe even eliminate it. Here’s the reality: bias in AI isn’t just a technical flaw. It’s a reflection of the world your data comes from. There are different types: - Historical bias comes from the inequalities already present in society. If the past was unfair, your model will be too. - Sampling bias happens when your dataset doesn’t reflect the full population. Some voices get left out. - Label bias creeps in when human annotators bring their assumptions to the task. - Measurement bias arises when we use poor proxies for real-world traits, like using postcodes as a stand-in for income. - Feedback loop bias shows up when algorithms reinforce patterns they’ve already learned, especially in recommender systems or policing models. You won’t fix this with good intentions. You need process. 1. Explore your dataset Use tools like pandas-profiling, datasist, or WhyLabs to audit your data. Look at the distribution of features. Where are the gaps? Who’s overrepresented? Are protected groups like gender, race or age present and balanced? 2. Diagnose the bias Use fairness toolkits like Fairlearn, AIF360, or the What-If Tool to test how your model behaves across different groups. Common metrics include: - Demographic parity (same outcomes across groups) - Equalised odds (same true and false positive rates) - Predictive parity (equal accuracy) - Disparate impact ratio (used in employment law) There’s no one perfect measure. Fairness depends on the context and the stakes. 3. Apply mitigation strategies Pre-processing: Rebalance datasets, remove proxies, use reweighting or SMOTE. In-processing: Train with fairness constraints or use adversarial debiasing. Post-processing: Adjust decision thresholds to reduce group-level disparities. Each approach has pros and cons. You’ll often trade a little performance for a lot of fairness. 4. Validate and track Don’t just run once and forget. Track metrics over time. Retrain with care. Bias can creep back in with new data or changes to user behaviour. 5. Document your decisions Create a clear audit trail. Record what you tested, what you found, what you changed, and why. This becomes your defensible position. Regulators, auditors, and users will want to know what steps you took. Saying “we didn’t know” won’t be good enough. The legal landscape is catching up. The EU AI Act names bias mitigation as a mandatory control for high-risk systems like credit scoring, hiring, and facial recognition. And emerging global standards like ISO 23894 and IEEE 7003 are pushing for fairness assessments and bias impact documentation. So, can I eliminate bias completely? ⚠️ Warning: Don’t follow the OpenAI prompting advice released yesterday unless you want biased outputs that reinforce gaps between your students. Yesterday, OpenAI released a K12 prompting guide (in comments). It scaffolded ‘okay’, ‘good’ and ‘great’ prompts, and celebrated the success of those labelled as “great”. But there’s nothing to celebrate here. In fact, there’s more to fear. Many of the “great” examples rely on asking GenAI to produce 'engaging activities'. That sounds harmless. But when left open, the word “engaging” brings in all kinds of bias from the training data. Take this example prompt from the guide: “Create a lesson plan for a high school history class on World War II. Include an engaging activity, discussion questions, and suggestions for multimedia resources. Tailor the content for students with a basic understanding of 20th-century history.” The outputs this kind of prompt generates often favour dominant norms: here Western-Centric, neurotypical, gender under-representation, privileged. Thousands of teachers, lecturers and teacher educators are working every day to narrow these gaps in attainment. But vague prompts like “make it engaging” can quietly widen them, unless we know how to guide these tools with care. In my research on physics outputs from GenAI, I’ve started to categorise how this bias appears. It shows in how explanations are framed, who is represented, and which learners are centred. Over the next few weeks, I’ll be sharing a series that explores ten common forms of bias in GenAI lesson outputs, and how we can mitigate against them through more intentional prompting. It was frustrating the first time I heard “I treat all my patients the same” used as a defense when different groups experience different outcomes. How many of us have heard or even said that — only to realize later that good intentions alone don’t immunize us from bias? The recent STAT article about Black patients being dismissed as “hard sticks” during IV placements is a stark reminder: bias in medicine can be subtle. A sigh. A glance. A clinician giving up too soon. These moments seem small — but they erode trust and cause real harm. Training alone won’t suffice. We must pair awareness with system-level change: diverse care teams, standardized protocols that recognize and correct for bias, and institutional commitment to equity for every patient. Everyone has bias, yes, even you. 🫵 Ever been in a technical debate where the other side seems way too attached to their solution? Ever notice others feel the same way about you? Sometimes your solution is the right solution. But sometimes… It’s just bias. 🧠 Understanding Bias Bias gets a bad rep. Bias doesn’t always come from a negative space. In the context of technical solutions, bias usually forms from experience. Throughout our careers, we see countless architectures, patterns, outages, and wins. We remember what worked. We remember what didn’t. Over time, we build a gut sense of solutions that are safe based on our experiences. That gut sense is bias, and it’s often well intentioned. 💪 Working Through Bias (Without Ignoring It) - Accept that everyone has bias — including you. This is the hardest part. You need to assume that other people's biases stem from good intentions and real experience, just like yours do. With this assumption, you can have more objective conversations and begin hearing other perspectives. - Ask yourself: Is this solution based on reality or comfort? Why do you have a preference for your solution? Are you pushing a strategy? Are you avoiding something unfamiliar? Are you sticking to what has worked in the past? Understanding why you hold bias is key to making the case for your solution. - Use data to guide the decision, but make sure it’s objective. Data makes decisions easier, but be careful. Bias can influence what data you choose to look at. Sometimes we subconsciously cherry-pick data that supports our views. It’s essential to take an objective look at the data, even if it challenges your case. - Bring in a trusted third party — but present data carefully. An impartial opinion can help, but only if you give the whole picture. When bringing in a third party, it’s crucial to present solutions and data objectively; that way, you get their honest opinion, not your opinion echoed back to you. 🧩 Final Thoughts The most important part of technical decision-making is accepting the possibility that you might be wrong. On many occasions, I've had to step back, evaluate my own bias, review the data objectively, and listen to opposing views. Your AI recruitment tool is probably biased. The real problem? Your tech team might not have the skills to spot it. Or does not know how to fix it. I've been deep in dissertation mode, processing almost 2,000 papers for my literature review on AI, gender equity, and HR, with a side topic of Human-AI collaboration(yes, I counted). Most of the papers are theory built on theory built on theory. Important work, but not exactly helping leaders figure out what to do Monday morning. We're drowning in frameworks while discrimination gets coded into systems every day. Zhou et al.'s (2023) research stands out refreshingly from the usual suspects. While most researchers are building increasingly complex mathematical frameworks to measure bias (here's your fish) Zhou's team asked a different question: What if we taught people to recognize bias themselves? (here's how to fish). Instead of another framework, they built hands-on tutorials where AI developers actually manipulate biased datasets and watch AI predictions change in real-time. It's just a python code away: You're tweaking a recruitment algorithm's training data. Add more male engineers from 2010. Watch the AI suddenly score women's resumes lower. Remove those data points. Watch scores equalize. That's bias becoming code in real-time. The results? 18 participants (small study, big implications) showed measurable improvements in both recognizing AND addressing bias after these tutorials. Not from lectures. Not from frameworks. From experiencing it themselves. Why this matters for leaders: 1-Your tech teams might not recognize bias when it's happening 2-Your HR teams might not understand how it gets encoded 3-Traditional AI and CS training isn't bridging this gap. But there are times when our own biases can affect that ability. And for execs, these patterns can be even harder to spot because people are less likely to point them out. That's why self-awareness is so important. When you catch yourself operating on autopilot, you can pause, think critically, and make decisions that actually reflect how you want to lead. Even the best leaders aren't immune to biases. What's important is that you recognize them within yourself and push back against them when they come up. There are also a few techniques that we can explore from a technical aspect to reduce this bias: 𝐌𝐨𝐝𝐞𝐥-𝐫𝐞𝐥𝐚𝐭𝐞𝐝 𝐭𝐞𝐜𝐡𝐧𝐢𝐪𝐮𝐞𝐬: 1.
