    When someone asks “Why did the model make that decision?” and the room goes quiet the problem rarely starts with the model. It usually starts with how the system was designed. In the latest edition of The Data Science Decoder, I explore why explainability often becomes difficult only after deployment and why trying to retrofit transparency later creates what I call black box panic. The article, “Trust by Construction: Embedding Explainability Into System Design,” argues that explainability isn’t a reporting layer. It’s a structural property of the decision architecture. If visibility isn’t designed into data flows, decision logic, thresholds, and policy alignment from the start, explanations become technical artifacts rather than meaningful answers. This matters because most stakeholders don’t ask model questions. They ask decision questions. Why was this customer declined? Why did outcomes change this month? Why does the system behave differently across segments? Answering these requires more than feature importance. It requires systems designed to make reasoning traceable, reproducible, and aligned with business intent. The organizations that do this well don’t treat explainability as governance overhead. They discover it improves adoption, exposes hidden dependencies, and surfaces unintended incentives earlier. Trust becomes something built into the architecture rather than negotiated after the fact.     AI you can test, certify, and trust 🚨 Mira Murati’s Thinking Machines Lab has just published its first research on whether AI can be trusted to deliver answers that are consistent and reproducible. The first wave of the AI race was about scale: more parameters, more compute, more speed. Murati’s $2B venture is rewriting the rules. The new competition is about certainty, how reliable and transparent a model is. To test consistency, the team ran Alibaba’s Qwen-235B model on the exact same prompt 1,000 times: “Tell me about Richard Feynman.” Feynman, a Nobel Prize–winning physicist, was born in Queens, New York: is a fixed fact. A reliable system should return it consistently. Instead, the model produced 80 variations and the answers split between “Queens, New York” and "New York City.” A detail? Not really. If AI can’t be consistent on a birthplace, how can it do so with compliance filings, medical records, or financial risk assessments? The breakthrough: determinism 🔹 Researcher Horace He traced the issue to the way GPUs order operations when handling multiple queries. 🔹 The fix: redesign three core functions to have identical outputs regardless of server load. 🔹 The result: 1,000 runs, 1,000 identical completions. ➡️ AI moved from probabilistic to predictable: from a machine changing its mind to a system that can be tested, certified, and trusted. Determinism comes at a cost. Speed slowed down: ▫️ Standard setup: ~26s ▫️ Deterministic (early): ~55s ▫️ Deterministic (improved): ~42s But in high-stakes settings, reliability outweighs raw performance. A bank or hospital can wait 20s longer for consistent, auditable and certifiable answers. Murati's philosophy: openness as an edge Where OpenAI has grown more secretive, Thinking Machines Lab leans into transparency. Their new blog details the research, and the code has been released for anyone to test. Determinism + openness = a double trust signal: The model behaves the same every time. The method is open and verifiable. This positions Thinking Machines Lab as the counter to black-box AI. Why this matters ✔️ Enterprises: Reproducibility may become a procurement criterion. Inconsistent models bring risks: liability, brand damage, failed audits. ✔️ Regulators: Under the EU AI Act, reproducibility could be to AI what accounting standards are to finance: the foundation of trust. The first wave of AI was defined by speed and scale. The second by consistency, transparency, and trust.   • Imagine buying a box of cereal, yogurt, or sauce, but none of them have nutrition labels. No ingredients, no context, no information. Would you trust what is inside and buy them anyway? Probably not.    Transparency influences trust in every part of our lives, including the AI we use each day. Knowing how a feature is built, what data it is trained on, and what safeguards guide its behavior helps people make informed and confident choices.    That is why we created the first version of the Autodesk AI Transparency Cards. Inspired by nutrition labels, the cards explain what the feature does, the model used, how it was trained, the protections in place, and the limitations to consider.    But information alone is not enough. Just as consumers learned to read nutrition labels, we also need education around AI. To support this, we published an e-book on Autodesk’s Trusted AI practices and added detailed explanations of each part of the Transparency Cards on the Autodesk Trust Center.     This paper explores how to measure and manage uncertainty in LLMs used in medicine. It focuses on making AI outputs safer, easier to interpret, and more aligned with clinical needs. 1️⃣ More importantly, it reframes uncertainty not as a flaw, but as a necessary and ethical feature of responsible AI. The authors argue that embracing controlled ambiguity, instead of always seeking perfect answers, leads to safer and more trustworthy systems. 2️⃣ The authors propose a detailed framework that combines statistical tools (like Bayesian inference and dropout sampling) with language-based analysis (such as measuring unpredictability in words) to detect how confident or uncertain LLMs are when answering medical questions. 3️⃣ It distinguishes two types of uncertainty: epistemic, which comes from gaps in the model’s knowledge or training data, and aleatoric, which comes from randomness and unpredictability in real medical cases like disease progression. 4️⃣ Because some models like GPT-4 do not reveal their internal confidence scores, the authors use surrogate models (such as Llama-2) that do. These models help estimate how uncertain the original system is. The framework also uses continual learning to keep the AI’s knowledge current—so it can adapt to new treatments, updated guidelines, or evolving clinical practices. 5️⃣ The paper promotes explainable tools, including visual maps of uncertainty and confidence scores. These help healthcare professionals easily identify when the AI is uncertain and decide when human judgment is necessary. 6️⃣ Rather than trying to eliminate uncertainty, the authors encourage a change in mindset. They suggest treating uncertainty as a helpful signal. Designing AI to admit when it is unsure builds trust and reduces the risk of overconfidence in high-stakes decisions. 7️⃣ The study emphasizes that user trust depends on many factors, including a clinician’s background, expectations, and how clearly the AI explains itself.     🛑AI Explainability Is Not Optional: How ISO42001 and ISO23053 Help Organizations Get It Right🛑 We see AI making more decisions that affect people’s lives: who gets hired, who qualifies for a loan, who gets access to healthcare. When those decisions can’t be explained, our trust erodes, and risk escalates. For your AI System(s), explainability isn’t a nice-to-have. It has become an operational and regulatory requirement. Organizations struggle with this because AI models, especially deep learning, operate in ways that aren’t always easy to interpret. Regardless, the business risks are real and regulators are starting to mandate transparency, and customers and stakeholders expect it. If an AI system denies a loan or approves one person over another for a job, there must be a way to explain why. ➡️ISO42001: Governance for AI Explainability #ISO42001 provides a structured approach for organizations to ensure AI decisions can be traced, explained, and reviewed. It embeds explainability into AI governance in several ways: 🔸AI Risk Assessments (Clause 6.1.2, #ISO23894) require organizations to evaluate whether an AI system’s decisions can be understood and audited. 🔸AI System Impact Assessments (Clause 6.1.4, #ISO42005) focus on how AI affects people, ensuring that decision-making processes are transparent where they need to be. 🔸Bias Mitigation & Explainability (Clause A.7.4) requires organizations to document how AI models arrive at decisions, test for bias, and ensure fairness. 🔸Human Oversight & Accountability (Clause A.9.2) mandates that explainability isn’t just a technical feature but a governance function, ensuring decisions are reviewable when they matter most. ➡️ISO23053: The Technical Side of Explainability #ISO23053 provides a framework for organizations using machine learning. It addresses explainability at different stages: 🔸Machine Learning Pipeline (Clause 8.8) defines structured processes for data collection, model training, validation, and deployment. 🔸Explainability Metrics (Clause 6.5.5) establishes evaluation methods like precision-recall analysis and decision traceability. 🔸Bias & Fairness Detection (Clause 6.5.3) ensures AI models are tested for unintended biases. 🔸Operational Monitoring (Clause 8.7) requires organizations to track AI behavior over time, flagging changes that could affect decision accuracy or fairness. ➡️Where AI Ethics and Governance Meet #ISO24368 outlines the ethical considerations of AI, including why explainability matters for fairness, trust, and accountability. ISO23053 provides technical guidance on how to ensure AI models are explainable.     Is the AI you’re using healthy for you? Kasia Chmielinski argued that just as food products come with nutrition labels detailing their ingredients, AI systems should also have clear labels that inform users about their data sources, algorithms, and decision-making processes. This transparency helps users understand how AI systems function and what influences their outputs. Users can make informed decisions about whether to trust and use a particular AI. This empowerment is crucial in a world where AI increasingly impacts daily life. But design and global standardization of these AI “nutrition labels” are still absent. Calls for global consensus on AI transparency standards are yet to be noticed. Putting it into motion through legislations and reinforcing this practice will be another story. In the meantime, here are 5 practices we can undertake to ensure that we’re using healthy AI systems in our organizations. 1️⃣ Demand transparency from vendors. Understand the training data, the model's decision-making process, and any biases that might exist. 2️⃣ Incorporate ethical considerations into your AI strategy. This will create a culture of ethical AI use in your organization. 3️⃣ Assess your AI system for biases, errors, and vulnerabilities. This confirms that the system is operating as intended and ethically. 4️⃣ Collaborate and create your standards. Engage with industry groups, policymakers, and academic institutions to help shape the development of global standards for AI transparency and ethics. 5️⃣ Invest in Explainable AI (XAI). Develop or choose AI systems that provide clear explanations for their decisions. By taking these steps, we can move towards a future where AI is developed and used responsibly, benefiting society as a whole.     As AI becomes integral to our daily lives, many still ask: can we trust its output? That trust gap can slow progress, preventing us from seeing AI as a tool. Transparency is the first step. When an AI system suggests an action, showing the key factors behind that suggestion helps users understand the “why” rather than the “what”. By revealing that a recommendation that comes from a spike in usage data or an emerging seasonal trend, you give users an intuitive way to gauge how the model makes its call. That clarity ultimately bolsters confidence and yields better outcomes. Keeping a human in the loop is equally important. Algorithms are great at sifting through massive datasets and highlighting patterns that would take a human weeks to spot, but only humans can apply nuance, ethical judgment, and real-world experience. Allowing users to review and adjust AI recommendations ensures that edge cases don’t fall through the cracks. Over time, confidence also grows through iterative feedback. Every time a user tweaks a suggested output, those human decisions retrain the model. As the AI learns from real-world edits, it aligns more closely with the user’s expectations and goals, gradually bolstering trust through repeated collaboration. Finally, well-defined guardrails help AI models stay focused on the user’s core priorities. A personal finance app might require extra user confirmation if an AI suggests transferring funds above a certain threshold, for example. Guardrails are about ensuring AI-driven insights remain tethered to real objectives and values. By combining transparent insights, human oversight, continuous feedback, and well-defined guardrails, we can transform AI from a black box into a trusted collaborator.
