How do you fix bad data in machine learning?

A major problem that data teams overlook during the data preparation phase for a machine learning project is the phase just before it: scoping. Bad scoping will result in a waste of time and resources. So, the first thing I would add is irrelevant data. I would also add: 1. Inaccuracy (including mislabeling), e.g., due to mistakes in data entry or measurement process. 2. Bad scaling: when data is recorded in different units or scales. 3. Duplicate values: especially with the absence of a unique identifier for each observation. 4. Renaming noise to corrupted data: Corrupted is more suited and specific relative to how noise is defined.

The service I was working with had a series of ML models that ran in series and passed their output to the next model, and the first one was an ASR text transcription model. Not all data that is an outlier or anomaly data is bad data. If we expect such data in real life then better to add more such data using synthetic data for such cases and train the model to handle it. The approach completely depends on the problem statement at hand.

Extending @Isham Rashik 's answer - a tool I use quite often is CleanLab, that uses confidence learning to automatically flag bad samples. It's perfect for quickly iterating and re-labeling your data, without training your models on top of it.

One benefit of doing it at source is that it eliminates effort to solve at several upstream systems and rather fixes the issues at the source.
